The 5 Real Capabilities Your Engineering Team Needs Before AI Actually Works

As per Deloitte, 70-85% of AI initiatives fail to meet expectations, and 42% of companies abandoned most of their AI initiatives in 2025 (a 17% year-over-year increase).

The gap between building and production deployment has become the primary bottleneck preventing many organizations from realizing ROI on their AI investments.

So why is only a small fraction of companies successfully deploying AI into production, and why are so many still stuck?

Let's set the AI hype aside for a moment (even though AI hype is currently at its peak). Having experimented with, built, and deployed multi-agent, RAG, and AI observability systems, I can tell you firsthand that AI is not a silver bullet. In fact, it amplifies your existing engineering problems. If your deployment pipelines are broken and your data is a mess, AI will just help you ship the wrong things faster. To get past the hype and see genuine returns, leaders need to treat AI adoption as an opportunity to clean up their mess first, and then begin AI implementations.

Based on my own time experimenting, building, and deploying, and Google's Research and Assessments, here are the 5 foundational capabilities you actually need to cultivate to make AI work:

1. Quality Internal Platforms (The "Digital Factory")

This platform is best understood as an internal product designed for your developers. It removes underlying complexity, allowing teams to focus on delivering user value rather than navigating infrastructure, security, and operational hurdles. Google’s research found that the positive effect of AI adoption on organizational performance depends on the quality of the internal platform.

The Reality: In many enterprises, developers spend up to 40% of their time wrestling with infrastructure provisioning, fragmented security compliance, and convoluted deployment pipelines rather than writing code. Without a unified Internal Developer Platform (IDP), AI tools simply generate code that gets stuck in these same operational bottlenecks.

The Solution: Focus on developing a platform where the primary goal is to reduce the cognitive load on developers by removing underlying complexity. Your starting point for developing such a platform could be Google’s “shift down” platform strategy. Instead of forcing individual developers to handle everything (security, compliance, and infra) early in the process that can overwhelm them, Google's approach is to shift those responsibilities down into the platform itself.

Start with a “minimum viable platform”. Instead of trying to build a comprehensive platform from the beginning, focus on solving one core high-value problem for a specific set of users. Identify the 'golden' path for the most common workflow, and build just enough to make that journey better.

2. Healthy Data Ecosystems

Building a high-quality, unified data ecosystem actually drives better organizational performance than simply adopting AI on its own.

No LLM can magically provide exact solutions to complex engineering or business problems. Even state-of-the-art models—such as the recently launched Opus 4.6, which leads benchmarks for real-world professional tasks—will hallucinate or underperform if they are provided with wrong or incomplete data. If your data is siloed or outdated, the system breaks down. Downstream AI agents will simply hallucinate at scale or perform well below expectations.

The Reality: You must break down silos and create a unified single source of truth. Structure your product catalogs, HR policies, and operational manuals into well-governed data domains before you even think about plugging an LLM into them.

The Solution: Use tools and platforms that make it easy for teams to discover and access the data they need, along with strong security controls:

  • Microsoft (Purview + SharePoint + Fabric): Best for organizations already integrated into the Office 365 ecosystem.
  • Google (Dataplex + BigQuery + Vertex AI): Ideal for custom, customer-facing apps or massive, petabyte-scale product data.
  • Atlan: Best for modern data stacks (e.g., Snowflake, Slack) where you want non-technical team members to act as data stewards.

3. AI-Accessible Internal Data (Context Engineering & RAG)

To unlock real value in multi-agent architectures, you must move to context engineering.

The Reality: We implemented a robust Retrieval-Augmented Generation (RAG) system for a client, where the context (actual intelligence) was stored in siloed DBs, Confluence pages, and docs. When a user asks a specific or even a technical question, the RAG system retrieves the exact, up-to-date documentation to generate a highly accurate, cited answer. This transforms a generic LLM into a specialized internal expert.

The Solution: Experiment with frameworks such as LangChain, which provides a comprehensive set of tools for building Retrieval-Augmented Generation (RAG) applications. Launch it for a few internal users and test the feedback. However, RAG implementation is a process of trial and error. A successful implementation must be executed by both technical and functional teams. Functional teams are of great importance as they provide your "ground truth" and help ground your responses.

4. Clear and Communicated AI Stance

A clear policy provides the psychological safety needed for effective experimentation.

The Reality: In the absence of clear guidelines, "shadow AI" runs rampant. Employees routinely paste sensitive proprietary code and customer data into public LLMs just to get their jobs done. To prevent data leaks, organizations must replace ambiguous bans with secure, accessible internal AI environments guided by clear, ethical, and frugal principles.

The Solution: Establishing an AI stance is an evolving journey, rather than a simple checklist. It requires executive sponsorship, with leadership clearly defining the mission, goals, and adoption strategy. The policy itself should be crafted by a cross-functional group of engineering, legal, security, IT, and product leaders. This team must also assign long-term owners to verify updates and handle feedback loops. 5. User-Centric Focus

All software is made for human users (at least until now). Teams must continuously align their priorities in service of the end user. In fact, a user-centric focus can also improve the quality of life for developers, lifting job satisfaction and productivity while reducing burnout.

The Reality: Many engineering teams get caught in the "velocity trap," celebrating how fast AI allows them to close tickets without measuring if those features actually improved the customer experience. Producing code faster means nothing if it doesn't solve the user's actual problem.

The Solution:

  • Make user metrics visible: If dashboards only show metrics like team velocity and deployment frequency, the user is easily forgotten. To shift to a user-centric focus, display user experience and engineering metrics in team or product planning meetings. Consider product success metrics like those in the H.E.A.R.T. framework.
  • Consider spec-driven development (SDD): An emerging development paradigm aims to provide a structure around which large language models (LLMs) may be oriented toward user needs: spec-driven development (SDD). An example is Spec-kit which is GitHub’s version of SDD. It can create workspace setups for a wide range of common coding assistants. Once that structure is set up, you interact with spec-kit via slash commands in your coding assistant.

The Verdict: AI is a Forcing Function

The current AI hype cycle will eventually stabilize, but the structured disruption it brings to software engineering is here to stay.
